Such a great quick fix. Bought a new 3rd party controller and the experience was awful.
This tip saved me 40-50 bucks for an original controller. Plus, I would have hated to throw it away. Thank you!

Did a step further, took the metal piece that was rusted out (don't let the battery there if you don't use the controller)
Used 99% alcohol in a little cup, put the metal piece inside and pour the alcohol till covered. Then I rubbed with a no longer used toothbrush and should come out pretty easily. If rust is still there, just rub with another type of metal to take the rust off till clean metal appears.
Then the tricky part is to insert the metal to the battery pack again, took me 10min, you should hear a click if inserted correctly.
