I compare my DIY homebuilt thermoelectric cooler prototype with an inexpensive store bought version, as well as a more expensive compressor based fridge/freezer.

I have peltier 12v 5A and I use 3.5A only, voltage is set about 8V, but I have circuit build to set steady current, because voltage is changing when cold side is cooling down, I have a lot of more efficiency rather using 5A. I am loosing only few degrees, but performance is doubled.
Data sheet is said that best performance compared to speed of cooling to power consumption is recommended to set current to about 70%. I did it and I am very happy.

Try give your water cooled one's radiator to have some clearance to blow the hot air out from the other side, it can make a huge difference
